Walkthrough

This change adds batched tensor operations and autograd support, attention and normalization primitives and layers, and a Shakespeare character-level transformer example. It also extends softmax and linear operations and updates related tests.

Changes

Transformer and neural-network building blocks

Layer / File(s) Summary
Tensor operations and autograd
src/arraymancer/tensor/operators_blas_l2l3.nim, src/arraymancer/tensor/shapeshifting.nim, src/arraymancer/tensor/private/p_shapeshifting.nim, src/arraymancer/autograd/gates_basic.nim, src/arraymancer/autograd/gates_blas.nim, src/arraymancer/autograd/gates_shapeshifting_views.nim, src/arraymancer/autograd/private/p_broadcast.nim, tests/nn/test_attention.nim
Tensor multiplication now supports broadcasted batch dimensions. Transpose operations and autograd gates support batched gradients, broadcast-aware addition and subtraction, scalar scaling, and permutation.
Softmax and rank-flexible linear operations
src/arraymancer/nn_primitives/nnp_softmax.nim, src/arraymancer/nn/activation/softmax.nim, src/arraymancer/nn_primitives/nnp_linear.nim, src/arraymancer/nn/layers/linear.nim, src/arraymancer/nn_primitives/nnp_embedding.nim, src/arraymancer/nn/init.nim, tests/nn/test_attention.nim
Softmax accepts an axis and computes gradients along it. Linear operations preserve leading input dimensions, and embedding backward accumulates gradient rows. Tests cover softmax gradients and rank-3 linear output and gradients.
LayerNorm and RMSNorm
src/arraymancer/nn_primitives/nnp_layernorm.nim, src/arraymancer/nn/layers/layernorm.nim, src/arraymancer/nn_primitives/nnp_rmsnorm.nim, src/arraymancer/nn/layers/rmsnorm.nim, src/arraymancer/nn/optimizers/optimizers.nim, src/arraymancer/nn.nim, src/arraymancer/nn_primitives.nim, tests/nn/test_layernorm.nim, tests/nn/test_rmsnorm.nim, tests/tests_cpu.nim
LayerNorm and RMSNorm primitives, backward operations, and trainable layers are added and exported. Tests check numerical gradients and layer shapes. Optimizers skip nil variables when collecting parameters.
Attention primitives and multi-head layer
src/arraymancer/nn_primitives/nnp_attention.nim, src/arraymancer/nn/layers/attention.nim, src/arraymancer/nn.nim, src/arraymancer/nn_primitives.nim, tests/nn/test_attention.nim, tests/tests_cpu.nim
Causal masks and scaled dot-product attention are added. MultiHeadAttention projects, splits, attends, merges, and projects its input. Tests cover attention values and gradients.
Shakespeare transformer training example
examples/ex08_transformer_shakespeare.nim
The example trains a character-level transformer on Shakespeare text and generates samples.

Before / after behavior

  • observed — Modified behavior in src/arraymancer/autograd/gates_basic.nim: The module now imports private/p_broadcast in addition to autograd_common.
  • observed — Modified behavior in src/arraymancer/autograd/gates_basic.nim: Added a broadcast-add gate and +. overload for two variables. The backward pass reduces the output gradient to each input’s shape when that input requires gradients; the operator checks contexts when bound checks are enabled and caches the gate when either input needs gradients.
  • observed — Modified behavior in src/arraymancer/autograd/gates_basic.nim: Added a broadcast-subtract gate and -. overload for two variables. Its backward pass reduces the gradient to each input’s shape when required, negating it for the right input; the operator uses the same conditional context check and gate-caching rules as broadcast addition.
  • observed — Modified behavior in src/arraymancer/autograd/gates_basic.nim: Added +. overloads for adding a tensor value to a variable in either operand order. The variable-first overload converts the tensor through the variable’s context; the reverse-order overload delegates to it.

RetriggerConfidence Score: 2/5

[Medium risk] Adds transformer layer implementations and supporting autograd operations.

The PR should not merge until causal masking and normalization’s sliced-view and backward-buffer handling are corrected.

Findings

  1. P1 Causal mask is dropped ▶
  2. P1 Sliced inputs read wrong rows ▶
  3. P1 Backward reads beyond short tensors ▶
  4. P2 Empty prompt breaks sampling ▶

Summary

The PR adds batched tensor and autograd operations, attention and normalization layers, and a Shakespeare transformer example, with neural-network tests. Review findings concern combined causal/padding masks, normalization of sliced tensor views, validation in exported backward kernels, and empty-prompt generation.

Thank you so much for your contribution.

Please note that I am currently writing a new tensor library though focused on inference, with first-class GPU support (Cuda, Metal, OpenCL, Vulkan and WebGPU at the moment, Hip when I have AMD hardware):

It currently supports Multi-Head Attention (MHA), Grouped-Query Attntion (GQA), Sliding-Window Attention (SWA), Multi-Head Latent Attention (MLA), Kimi Delta Attention (KDA), Gated Delta Net (GDN) through libtorch and tested through:

My current focus is to completely remove libtorch dependency and replace it with pure Nim: https://github.com/mratsim/tattletale/tree/885f623/workspace/positron/src/kernels/ceramic/attn_ssm (The tile algebra API will see complete refactoring though, probably tonight or within the week)

@mratsim thank you Mamy for all of the inspiring work you've put into the Nim ecosystem! 🙏

yes, i am subscribed to tattletale as well. if you decide to move that towards a full fledge training library, i'd be happy to start contributing there. otherwise i thought it'd be nice to just have the basic primitives needed for a transformer here given an old issue i'm following
